Evaluation
The effectiveness of the developed algorithm was assessed by measuring the time lag between the initial alert generated by the system and the subsequent appearance of the corresponding fault code. This evaluation method demonstrates the algorithm’s ability to provide early warnings ahead of actual fault occurrences, enabling proactive maintenance and reducing downtime.
Fuel rail pressure refers to the pressure of fuel within the fuel rail (pipe or chamber) that distributes fuel to the fuel injectors in an internal combustion engine, especially in modern fuel injection systems such as common rail diesel engines. This pressure is crucial because it determines how much fuel is delivered to the engine cylinders and how finely the fuel is atomized for efficient combustion.
Proper fuel rail pressure ensures the correct air-fuel mixture for combustion, which affects power, emissions, and engine longevity
What causes high or low fuel rail pressure ?
Faulty Fuel Pressure Regulator: If the regulator malfunctions or its valves stick closed, it can cause excessive pressure buildup in the fuel rail by restricting fuel return .
Obstructed Fuel Return Lines: Blockages or restrictions in the return lines prevent excess fuel from flowing back to the tank, raising pressure in the rail.
Clogged Fuel Filter: Over time, dirt and debris clog the fuel filter, restricting fuel flow and lowering pressure in the fuel rail
Fuel Rail Relief Valve Failure: A stuck or defective pressure relief valve can fail to release excess pressure.
Engine may crank but fail to start or stall frequently; poor engine performance such as bad pickup, backfiring, and rough running; Increased risk of piston damage due to lean combustion, which can cause pistons to overheat, melt, or score cylinder walls; Potential damage to the catalytic converter due to incomplete combustion leading to excessive pollution.
Gaussian Mixture modelling for identifying outliers - By closely examining the data, I noticed it followed a bell-shaped pattern, similar to a normal/Gaussian distribution. To analyze this, we used a technique called a Gaussian Mixture Model, which helps identify different healthy groups within the fuel rail pressure data. In this approach, any data point that falls far outside the typical range of the healthy data is flagged as an outlier, indicating it might be unusual or problematic.
Implementation
Data Aggregation: Engine RPM data was segmented into bins, and for each bin, fuel rail pressure data was aggregated, there were visible multi-modal clusters.
Model Training: A Guassian mixture model was fitted on each of these bins, with their respective covariances and means captured.
Anomaly Detection: The trained model was then being inferred with the averaged out fuel rail pressure data, based on the standard deviation by which it deviated from the means of the respective clusters, it was bein either tagged as high outlier (highFRP) or low outlier (lowFRP) or optimal within distribution state (optimalFRP).
